A technically clean dataset can still encode an invalid decision process.

When to use

  • Use for training, evaluation, tuning, retrieval, feedback, or monitoring datasets tied to consequential outcomes.
  • Obtain qualified domain, legal, privacy, security, accessibility, fairness, safety, and affected-community review.

Preconditions

  • Establish independent data, domain, model-risk, legal, privacy, security, fairness, accessibility, safety, and release authority.
  • Define the decision, population, model role, human authority, jurisdictions, prohibited uses, harm thresholds, and appeal path.
  • Separate dataset approval from delivery pressure and commercial ownership where conflicts exist.

Procedure

Complete purpose, rights, and provenance, population, label, and quality analysis, versioning and access control, and release and monitoring before use.

  1. Build a dataset governance register for sources, collection purpose, rights, consent or authority, population, fields, labels, time, geography, owners, vendors, versions, and permitted uses.
  2. Trace every source and transformation, including sampling, filtering, joining, deduplication, annotation, adjudication, augmentation, synthesis, removal, and prior-model influence.
  3. Test whether the target and labels represent a valid, timely, observable domain outcome rather than convenience, historical policy, selective enforcement, or proxy prejudice. Require policy-conditioned label observability for every row: historical decision policy, model version, selection path, outcome maturity, and whether the outcome could ever be observed. Keep rejected applicants and selectively investigated cases explicitly unlabeled when outcomes are censored.
  4. Compare intended and observed populations across time, geography, institution, language, disability, access, missingness, and relevant subgroups.
  5. Measure selection, survivorship, measurement, label, annotation, missingness, leakage, duplicate-entity, feedback-loop, and evaluation contamination risks.
  6. Document annotation instructions, expertise, uncertainty, disagreement, adjudication, labor conditions, conflicts, and quality.
  7. Minimize sensitive fields, protect identity, govern linkage, and enforce purpose, access, retention, deletion, residency, and incident controls.
  8. Create immutable manifests for source snapshots, hashes, schemas, transformations, record disposition, split assignment, and dataset lineage.
  9. Prevent entity and temporal leakage across training, validation, and test sets; maintain independent challenge and postdeployment evaluation data.
  10. Evaluate coverage, calibration, performance, error severity, subgroup outcomes, intersectional uncertainty, robustness, and plausible distribution shift.
  11. Record exclusions, limitations, unsupported uses, residual risks, release conditions, human review, appeal, monitoring, and stop rules.
  12. Require independent approval and consumer attestation to the exact dataset generation and permitted use.
  13. Monitor source drift, label drift, access, deletion, feedback loops, performance, harm, appeals, and new uses after release.

Failure plan

  • If purpose, rights, provenance, or label validity is unresolved, do not release the affected data for high-stakes use.
  • If a subgroup is too sparse for a reliable claim, report uncertainty and restrict the use rather than claiming parity.
  • If a deletion or correction changes derived sets, propagate a new generation and invalidate affected descendants.
  • If monitoring finds material harm or out-of-scope use, suspend access or deployment and activate remediation.

Worked example

A lender wants one dataset for credit eligibility and fraud models across countries, combining historical approvals, repayment, manual investigations, bureau data, device signals, customer appeals, and prior-model scores, while past policies differed, rejected applicants lack outcome labels, identity and disability proxies may exist, vendor rights vary, and downstream teams want to reuse the data. Governance separates valid outcomes from historical decisions, maps selection and label gaps, controls rights and lineage, creates independent evaluation sets, restricts unsupported reuse, and monitors harm plus appeals.
